# Multi-Source Wasserstein Distributionally Robust Graph Learning (MS-WDRO)
## Overview
This skill implements the MS-WDRO framework from arXiv:2608.19914 for robust brain connectivity inference when target-domain samples are scarce but heterogeneous source-domain data are abundant. The framework addresses the critical challenge in neuroimaging where small clinical cohorts (target domain) must be analyzed using data from multiple larger studies conducted at different sites under varying protocols (source domains).
## Key Contributions
1. **Multi-source WDRO Framework**: Fuses heterogeneous source distributions via their weighted Wasserstein barycenter as the nominal distribution of a Wasserstein ambiguity set
2. **Tractable Reformulation**: Derives closed-form tractable reformulation via Wasserstein strong duality, reducing to regularized Laplacian estimation with explicit Frobenius-norm robustness penalty
3. **Efficient ADMM Solver**: Two-block ADMM solver with closed-form per-iteration updates and provable convergence guarantees
4. **Rigorous Statistical Theory**: Provides finite-sample concentration bounds, pooling bias lower bounds, and out-of-sample excess risk guarantees
5. **Algorithm Unrolling**: Embeds the solver into a differentiable architecture for joint hyperparameter learning (ambiguity radius, sparsity, Lagrangian penalty, fusion weights)
## When to Use This Skill
Use this skill when:
- Analyzing brain connectivity with limited target samples but abundant heterogeneous source data
- Working with multi-site neuroimaging datasets (e.g., ABIDE consortium)
- Needing robust graph topology inference that handles distributional shifts between sites
- Dealing with sensor networks or social networks with heterogeneous sources
- Traditional graph learning methods fail due to mixing bias from naive data pooling
## Core Methodology
### Problem Setup
- **Target domain**: Scarce samples from rare clinical cohort (e.g., small ABIDE site like CMU)
- **Source domains**: Abundant data from larger studies at different sites with protocol variations
- **Challenge**: Naive pooling introduces mixing bias that grows with inter-source divergence
### MS-WDRO Framework
1. **Wasserstein Barycenter Fusion**: Compute weighted Wasserstein barycenter of source distributions as geometrically principled nominal distribution
- Preserves intrinsic geometry of each source
- Avoids covariance inflation inherent to mixture distributions
2. **Ambiguity Set Construction**: Build Wasserstein ball around barycenter to hedge residual uncertainty
- Radius ϵ controls robustness-conservatism trade-off
- Accounts for both sampling error and heterogeneity
3. **Minimax Optimization**: Minimize worst-case expected log-likelihood loss over ambiguity ball
- Yields regularized Laplacian estimator: `max_L log|L|+ - tr(Σ̂_λ L) - ρ||L||_F^2`
- Subject to combinatorial Laplacian constraints: `L ⪰ 0, L1 = 0, L_ij ≤ 0 for i≠j`
4. **ADMM Solver**: Efficient two-block alternating direction method of multipliers
- Closed-form updates for primal and dual variables
- Global convergence with O(1/K) ergodic rate
- Handles large-scale problems efficiently
5. **Algorithm Unrolling**: Differentiable architecture for automatic hyperparameter calibration
- Each ADMM iteration becomes a computational layer
- Four learnable parameters: ambiguity radius, sparsity coefficient, Lagrangian penalty, fusion weights
- End-to-end supervised training captures parameter interactions
## Implementation Guidelines
### Data Preparation
1. **Source Data**: Collect graph signals from M heterogeneous sources
2. **Empirical Distributions**: Compute empirical covariances Σ̂_m for each source
3. **Projection**: Apply projection P = I - (1/N)11^T to ensure null space consistency
4. **Reduced Space**: Work in 1^⊥ subspace using orthonormal basis U_⊥
### Wasserstein Barycenter Computation
```python
# Reduced fixed-point iteration in 1^⊥ subspace
for k in range(max_iter):
Sigma_bar_perp_k = sum(lambda_m * sqrtm(sqrtm(Sigma_bar_perp_k) @ Sigma_perp_m @ sqrtm(Sigma_bar_perp_k))
for m in range(M))
Sigma_bar_perp_k = sqrtm(Sigma_bar_perp_k)
# Lift back to ambient space
Sigma_bar_lambda = U_perp @ Sigma_bar_perp_k @ U_perp.T
```
### ADMM Solver Steps
1. **Initialize**: L^0, Z^0, U^0
2. **Primal Update**: Solve for L^{k+1} with closed-form solution
3. **Dual Update**: Update Z^{k+1} with proximal operator for sparsity
4. **Multiplier Update**: U^{k+1} = U^k + (L^{k+1} - Z^{k+1})
5. **Convergence Check**: Monitor primal-dual gap function
### Hyperparameter Calibration
- **Traditional**: Cross-validation over joint parameter space (computationally prohibitive)
- **MS-WDRO**: Algorithm unrolling with end-to-end training
- **Benefits**: Captures mutual parameter interactions, implicit annealing schedule, linear parameter growth
## Theoretical Guarantees
### Statistical Bounds
1. **Barycenter Concentration**: Finite-sample bound for empirical Wasserstein barycenter accuracy
2. **Pooling Bias Lower Bound**: Proves naive aggregation incurs strictly positive irreducible bias
- Scales with between-source mean dispersion H_λ
- Establishes asymptotic separation from barycentric approach
3. **Excess Risk Bound**: Out-of-sample risk decays at parametric rate with logarithmic source dependence
### Algorithmic Guarantees
- **Global Convergence**: Monotone primal-dual Lyapunov potential
- **Ergodic Rate**: O(1/K) primal-dual gap function convergence
- **Objective Convergence**: Guaranteed convergence to optimal solution
## Applications
### Primary Application: Brain Connectivity
- **Dataset**: ABIDE I multi-site functional neuroimaging
- **Challenge**: Small acquisition sites (target) vs. larger studies (sources)
- **Results**: Superior graph recovery accuracy, sample efficiency, and downstream diagnostic utility
- **Largest Gains**: In sample-scarce regime (primary motivation)
### Other Applications
- **Sensor Networks**: Different hardware characteristics monitoring shared phenomena
- **Clinical Federated Learning**: Hospital data heterogeneity precluding simple aggregation
- **Social Network Analysis**: Platform-specific behavioral norms across domains
## Pitfalls and Best Practices
### Common Pitfalls
1. **Naive Pooling**: Directly combining heterogeneous sources without geometric consideration
2. **Fixed Hyperparameters**: Using cross-validation instead of algorithm unrolling for calibration
3. **Ignoring Null Space**: Not projecting covariances to ensure L1 = 0 constraint satisfaction
4. **Single Source Assumption**: Applying single-source WDRO to multi-source problems
### Best Practices
1. **Geometric Fusion**: Always use Wasserstein barycenter for heterogeneous source fusion
2. **End-to-End Calibration**: Prefer algorithm unrolling over grid search for hyperparameters
3. **Subspace Projection**: Work in reduced 1^⊥ space for numerical stability
4. **Validation**: Test on both synthetic benchmarks and real multi-site datasets
