# Qwen-VL: A Versatile Vision-Language Model for Understanding, Localization, Text Reading, and Beyond
## One-line decision
Use this skill when you need a multi-stage data pipeline covering pretraining, multi-task training, and instruction tuning with grounding and OCR data. Avoid it when you need only basic image understanding without grounding or OCR capabilities.
## Skill metadata
- **Skill type**: multi-task-data-pipeline
- **Paper kind**: operational-method
- **Actionability**: high
- **Evidence quality**: full_paper
## Goal
Design a comprehensive multi-stage data pipeline that progressively adds capabilities (understanding, localization, text reading) through carefully curated data at each stage.
## Problem signature
- Modality: image-text pairs with bounding boxes, OCR annotations, and instruction-following data.
- Data state: multi-stage data: web-crawled pairs → multi-task grounding/OCR data → instruction tuning data.
- Scale regime: 1.4B web image-text pairs for pretraining; 100M multi-task samples; instruction tuning data.
- Model requirement: ViT-G vision encoder + Qwen-7B LLM with cross-attention adapter.
## Use when
- You need a VLM with both visual understanding and grounding/localization capabilities.
- You want to add OCR and text reading abilities to your VLM.
- You have access to multi-task data including detection, grounding, and OCR.
## Do not use when
- You only need basic image captioning without grounding.
- You cannot curate multi-task data with bounding box annotations.
- You need a lightweight model without multi-task complexity.
## Required inputs
- **pretraining_pairs**: Web-crawled image-text pairs cleaned and filtered.
- **grounding_data**: Data with bounding box annotations for visual grounding.
- **ocr_data**: Images with text content and OCR annotations.
- **instruction_data**: Instruction-following data for conversational fine-tuning.
## Optional inputs
- **interleaved_data**: Multi-image interleaved instruction data.
## Outputs
- **qwen_vl_model**: VLM with understanding, grounding, and OCR capabilities.
- **multi_task_data_pipeline**: Reusable data pipeline design for multi-capability VLMs.
## Assumptions and prerequisites
- Multi-stage training progressively builds capabilities.
- Grounding and OCR data must be introduced at the right stage.
- Bounding box representations in text format enable grounding without architecture changes.
## Procedure
1. **Stage 1: Pretraining on web data**
Action: Train on 1.4B cleaned web image-text pairs to learn broad visual-semantic alignment.
Why: Establishes foundational vision-language alignment.
Note: See paper for details.
2. **Stage 2: Multi-task training**
Action: Fine-tune on a mix of VQA, grounding, OCR, captioning, and detection data (~100M samples).
Why: Adds specific capabilities: localization, text reading, structured understanding.
Note: See paper for details.
3. **Stage 3: Instruction tuning**
Action: Fine-tune on conversational instruction data to enable interactive use.
Why: Makes the model useful for real-world applications.
Note: See paper for details.
4. **Evaluate across capability dimensions**
Action: Test on VQA, grounding, OCR, captioning, and dialogue benchmarks.
Why: Validates that all capabilities are present and functional.
Note: See paper for details.
## Parameters to set
- **pretraining_scale** — Role: Number of web pairs for stage 1. How to set: 1B+ for broad coverage. Default/range: 1.4B. Effect: More data improves foundational alignment.
- **grounding_format** — Role: How bounding boxes are represented in text. How to set: Normalized coordinates as special tokens. Default/range: (x1,y1,x2,y2) as text. Effect: Text-format boxes avoid architecture changes.
- **input_resolution** — Role: Image resolution during training. How to set: 448x448 for detail. Default/range: 448. Effect: Higher resolution improves OCR and grounding.
## Validation checks
- Grounding accuracy should match or exceed specialist models.
- OCR/text reading benchmarks should show strong performance.
- General VQA should not degrade when adding grounding and OCR capabilities.
## Failure modes
- Multi-task training may cause interference between capabilities.
- Grounding data quality directly impacts localization accuracy.
- OCR data must cover diverse text styles and languages.
## Adaptation notes for VLM training
- The multi-stage data pipeline pattern is adopted by many subsequent VLMs.
- Add domain-specific data at stage 2 for specialized capabilities.
- The text-format bounding box approach simplifies grounding without architecture changes.
## Implementation notes
- Use separate data loaders for each task to control the mixing ratio.
- Monitor per-task performance during multi-task training.
- Bounding box normalization is critical for consistent grounding.
## Evidence from the paper
- Qwen-VL achieves state-of-the-art on grounding, OCR, and VQA benchmarks simultaneously.
- The three-stage data pipeline (pretrain → multi-task → instruct) progressively builds capabilities.
- Text-format bounding boxes enable grounding without special architecture components.
- Qwen-VL handles English and Chinese, demonstrating multilingual VLM data design.
