## What This Skill Does
Replace uniform token-level policy optimization with perception-exploration gating that computes token advantages using dual signals: (1) visual alignment strength (cosine similarity to vision tokens) and (2) reasoning uncertainty (output entropy). Improves multimodal chain-of-thought reasoning by emphasizing tokens that are both visually grounded and uncertain.
## Problem with Uniform Token-Level RL
Standard token-level RL (GRPO, DAPO) assigns equal advantage weights to all tokens in the response sequence. This is suboptimal for vision-language models because:
- Not all tokens contribute equally to correct reasoning (some are explanatory filler)
- Some high-RL-loss tokens may be ungrounded hallucinations, not reasoning steps
- Entropy alone doesn't distinguish between productive uncertainty (reasoning) and noise
- Model wastes RL signal on tokens that don't anchor reasoning to visual input
The paper's insight: Successful multimodal CoT depends on a compact subset of visually-aligned tokens that anchor the reasoning process. RL should concentrate advantage weight on these grounded, uncertain tokens.
## The Swap: Uniform Advantages → Perception-Exploration Gating

- Datasets with diverse reasoning complexity (perception prior adapts to image complexity)
## When NOT to Use
- Pure text-only language models (no vision tokens to ground)
- Tasks where all tokens contribute equally (e.g., structured output with fixed format)
- Models where vision and text are processed independently without cross-attention
- Inference-only scenarios (PEPO is integrated into training loop)
- If compute overhead is critical (though <1% overhead is negligible in most cases)
## Implementation Checklist
To integrate perception-exploration gating:
1. **Extract vision hidden states**:
- Capture vision tower outputs during forward pass (typically before cross-modal fusion)
- Shape: (batch_size, num_vision_tokens, hidden_dim)
2. **Implement perception-exploration gating**:
- Compute perception prior: cosine similarity between response token hidden states and vision hidden states
- Compute exploration signal: output entropy per token
- Combine via gating: `(1 + α·tanh(entropy)) * perception_score`
- Softmax to normalize weights across sequence
3. **Integrate with token-level RL**:
- Replace uniform advantage computation with gated advantages
- Formula: `token_advantage[t] = reward * weight[t]`

- **Small batch effects**: With small batches, entropy estimates are noisier. Use batch_size >= 8 for stable gating signals.
