Two-level fast-slow neural-astrocyte architecture implementing a hybrid automaton for latent-context inference. Slow astrocytic RNN accumulates reward-prediction-error evidence; context switches emerge from a cascade of two bifurcations (attractor annihilation + level-set boundary crossing). Stickiness is mediated by environmental entropy flattening the unrewarded vector field. Astrocytic tiling/lattice topology suffices up to 90% sparsity.

# Neural-Astrocyte Hybrid Automaton for Evidence Accumulation
**Methodology from arXiv:2609.16217** — how a biologically inspired two-level neural-astrocyte network infers latent task rules from action-outcome histories, with context switching realized as a bifurcation-driven hybrid automaton rather than an explicit state machine.
## When to Use
- Modeling astrocytic (slow, modulatory) contribution to latent-rule inference in RL settings
- Designing hierarchical fast/slow architectures where a slow network reconfigures a fast task network (hypernetwork-style, via low-rank multiplicative gain)
- Analyzing trained RNN policies as dynamical systems: level sets, limit cycles, bifurcations, stickiness
- Building context-switching agents that must tolerate stochastic rewards and uncertain block lengths
- Understanding why astrocyte-like sparse/lattice topology does not degrade network-wide modulation
## Architecture: Two-Tier Fast-Slow Coupling
**Fast neuron network (N-RNN)** — millisecond-scale, task execution:
```
x_{t+1} = (1−τ_x)x_t + τ_x( W_eff(π_k)·tanh(x_t) + B_dx·u_t + ε_x )
y_t = W_qx·x_t
```
**Slow astrocyte network (A-RNN)** — trial-scale, contextual evidence integration:
```
h_{k+1} = (1−τ_h)h_k + τ_h( W_hh·tanh(h_k) + W_oh·o_k + b_h + ε_h )
g_{k+1} = argmax( Softmax( W_2·ReLU(W_1·h_{k+1}+b_1)+b_2 ) )
π_{k+1} = OneHot(g_{k+1})
```
with τ_h ≫ τ_x. The astrocytic action π_k is held **piecewise-constant across the whole fast trial**, modulating N-RNN effective connectivity:
```
W_eff(π_k) = J_xx ⊙ ( 11^T + H_px·diag(π_k)·H_px^T )
```
- Multiplicative Hadamard formulation = synaptic scaling; the tall H_px (M ≪ N_x) induces a **low-rank transformation**, capturing **astrocytic tiling** — modulation targets localized neuronal ensembles, not global uniform gain.
- A-RNN input o_k = (π_k, r_k): its own previous action + scalar reward. It never sees an oracle context signal.
## Task: Hierarchical Latent-Context Inference
- **Low level**: delayed match-to-sample (Romo-like) — hold stimulus over variable delay, reach target. Correct stimulus→target mapping depends on active latent context c_k ∈ {1..M}, M=4.
- **High level**: M-arm stochastic bandit. Blocks of L~U(3,25) trials; context then jumps uniformly. Correct context + correct execution → reward w.p. p*; wrong context yields reward w.p. (1−p*)/(M−1). Zero-reward is inherently ambiguous (context shift vs probabilistic omission).
- Four entropy regimes: H=0.627 (p*=0.90), 1.208 (0.75), 1.604 (0.60), 1.838 (0.48).
**Training decoupling**: N-RNN via supervised MSE on reach target; A-RNN via A2C+GAE on sparse one-bit trial reward, with a 500-trial reward-augmentation curriculum (r=10 → anneal → 1).
**Relation to prior art**: meta-RL (but policy is fixed, not adapting); hypernetworks (dynamic parameter selection via W_eff instead of input concatenation); context-based RL (context inferred autonomously, never given).
## Core Mechanism: Bifurcation-Cascade Hybrid Automaton
Trained agents (100 independent models) exhibit **sticky win-stay/lose-switch**: switching latency (number of successive unrewarded trials tolerated) grows with environmental entropy.
### Action level sets
Decoded contexts g_k are level sets of the readout: action c emitted for all h satisfying argmax(Softmax(...)) = c. Each level set contains **two limit sets**: a rewarded attractor (successive reward) and an unrewarded limit set (successive RPE).
### The switch = two sequential bifurcations
1. **Attractor annihilation**: reward omission (r_k=0) changes the (π, r) bifurcation parameters — the active stable limit cycle is destroyed; vector field reconfigures to the unrewarded regime.
2. **Boundary crossing + second bifurcation**: the state h flows autonomously through a **low-velocity flat region** within the current level set; once it crosses the decision boundary into a new action level set, the readout decodes a new action — inducing a second vector-field reconfiguration that resets the process toward a new attractor well.
**Interpretation**: a generalization of integrate-to-bound models where bifurcations *relocate multidimensional bounds in state space*. Discrete automaton transitions are implemented in continuous dynamics — no explicit state machine.
### Stickiness = vector-field flatness
- Distance/speed analysis over 100 agents: stickiness corresponds to the steepness (or flatness) of the unrewarded vector field proximal to the annihilated attractor.
- Higher environmental entropy → flatter landscape → more discrete steps to cross the decision boundary → longer stickiness.
- Residual variability at ε_h=0 comes from stochastic reward feedback itself: near-flat boundaries let randomness place trajectories in ambiguous multi-level-set interface zones → missed cycles, timing jitter.
## Astrocytic Tiling Suffices
- Biological astrocytes: sparse gap-junction networks, non-overlapping spatial domains (tiling), 1:3 astrocyte-to-neuron ratio.
- Lattice topology (k-nearest-neighbor banded recurrence) vs dense all-to-all: **comparable training rate and asymptotic regret**. Effective network-wide context integration emerges from purely local astrocytic interactions.
- Modulation remains efficacious up to **~90% connection sparsity** — robustness without fragility; global integration through local communication.
## Why Timescale Separation Aids Trainability
Monolithic RNN baseline (same parameter count, dual readout heads, policy-gradient): **fails to learn**. A single recurrent population must simultaneously preserve persistent low-frequency reward histories (context inference) and generate high-frequency transient dynamics (within-trial execution); high-variance policy-gradient updates overwrite slow credit assignment. The hierarchical decoupling assigns evidence integration to the slow A-RNN, providing a stable modulatory signal to the fast N-RNN.
## Implementation Guide
1. Instantiate the two-tier architecture: N-RNN (e.g., 128 units) + A-RNN (e.g., 64 units) with τ_h ≫ τ_x; wire W_eff = J_xx ⊙ (11^T + H_px diag(π) H_px^T) with M context channels.
2. Build the hierarchical env: DMS low-level task + stochastic bandit context blocks with ambiguous zero-reward; parameterize entropy via p*.
3. Train decoupled: supervised loss for N-RNN; A2C+GAE for A-RNN on sparse trial reward; use reward-magnitude curriculum (500 trials @ r=10, anneal 250).
4. Evaluate switching: P(switch at step k) across entropy × internal noise grid; action transition matrices P(π_{k+1}|π_k) for directional policy structure.
5. Dynamical analysis: identify readout level sets; clamp (π, r) pairs and integrate autonomous trajectories to locate rewarded/unrewarded limit sets per level set; measure normalized distance + instantaneous velocity from rewarded centroid h* to unrewarded centroid h†.
6. Ablate topology: dense vs lattice-k vs sparsity sweep (keep 1:3 astrocyte:neuron ratio); compare regret curves.
## Pitfalls & Best Practices
- **Per-trial supervised loss on A-RNN fails**: single-trial labels don't reveal latent context under stochastic rewards — RL (A2C+GAE) over multi-trial histories is required.
- **Don't reset hidden states at task boundaries**: A-RNN must evolve continuously across blocks; long-term history shapes the state-space trajectory. Periodic resets destroy evidence accumulation.
- **Hold π_k piecewise-constant during the fast trial**: mixing timescales within a trial breaks the modulatory interpretation.
- **Zero-reward ambiguity is the point**: if your env makes r=0 unambiguous, you've removed the evidence-accumulation pressure that produces stickiness.
- **Noise vs reward stochasticity**: behavioral dispersion at ε_h=0 is not a bug — it reflects genuine entropy-driven trajectory ambiguity near flat boundaries. Distinguish internal noise from environmental stochasticity in interpretation.
- **Oracle ceiling**: a supervised RNN given ground-truth context defines the performance ceiling; compare hierarchical model against both oracle and monolithic baselines, not just the oracle.
## Extensions & Applications
- Neuromorphic implementation: slow astrocytic variables as Ca²+ integrators gating fast spiking cores (gap-junction-coupled lattice maps to local crossbar modulation).
- Volatility-adaptive stickiness: parameterize context switch rates (block-length distribution) — animal stickiness tracks volatility; current model only samples U(3,25).
- Generalization: single pre-trained agent across structurally distinct task regimes likely needs meta-learning on top of this scaffold.
- Multi-context RL benchmarks where context must be inferred, not cued; hierarchical RL with slow-fast decomposition as an architectural prior for trainability.
- Empirical bridge: ventral striatal astrocytes contribute to RL (Pai et al. 2025); astrocytic futility-accumulation via noradrenergic pathways (Kalmbach et al.) — model gives a dynamical schema for how.
