# Vokenization: Improving Language Understanding with Contextualized, Visual-Grounded Supervision
## One-line decision
Use this skill when you want to augment text training data with visual tokens ('vokens') retrieved from an image database to ground language in vision. Avoid it when you do not need visual grounding of text data.
## Skill metadata
- **Skill type**: visual-grounding-of-text
- **Paper kind**: operational-method
- **Actionability**: medium
- **Evidence quality**: full_paper
## Goal
Augment text training data by replacing some tokens with 'vokens' — visually grounded tokens retrieved from an image database — adding visual supervision to language model training.
## Problem signature
- Modality: text tokens augmented with retrieved visual tokens (vokens).
- Data state: text corpus with vokens retrieved from image databases.
- Scale regime: standard text corpora augmented with visual tokens.
- Model requirement: Language model with visual token integration.
## Use when
- You want to add visual grounding to language training.
- You can retrieve relevant images for text tokens.
- You want visually grounded language representations.
## Do not use when
- Standard text training is sufficient.
- You cannot retrieve relevant images.
- Visual grounding is not needed.
## Required inputs
- **text_corpus**: Text data to augment with vokens.
- **image_database**: Database of images for voken retrieval.
- **retrieval_model**: Model for matching text tokens to images.
## Optional inputs
- **voken_integration**: Method for integrating vokens into training.
## Outputs
- **vokenized_corpus**: Text with visual token augmentation.
- **grounded_model**: Language model with visual grounding.
## Assumptions and prerequisites
- Visual grounding improves language understanding.
- Relevant images can be retrieved for text tokens.
- Voken-augmented training produces better representations.
## Procedure
1. **Build voken retriever**
Action: Train a model to retrieve relevant images for text tokens.
Why: Retrieval links text to visual content.
Note: See paper for details.
2. **Vokenize text corpus**
Action: Augment text tokens with retrieved visual tokens.
Why: Adds visual supervision to text training.
Note: See paper for details.
3. **Train with voken supervision**
Action: Include voken prediction as an auxiliary task.
Why: Visual grounding regularizes language learning.
Note: See paper for details.
4. **Evaluate grounding benefit**
Action: Compare vokenized to standard text training.
Why: Validates visual grounding benefit.
Note: See paper for details.
## Parameters to set
- **voken_coverage** — Role: Fraction of tokens vokenized. How to set: Vokenize visually groundable tokens. Default/range: Task-dependent. Effect: More coverage increases visual signal.
- **retrieval_quality** — Role: Quality of voken retrieval. How to set: Use CLIP or similar for retrieval. Default/range: CLIP-based. Effect: Better retrieval improves grounding.
## Validation checks
- Vokenized training should improve language understanding.
- Retrieved vokens should be relevant to text context.
- Visual grounding should help on grounding-related tasks.
## Failure modes
- Not all text tokens are visually groundable.
- Retrieval errors introduce noise.
- The benefit may be small for purely linguistic tasks.
## Adaptation notes for VLM training
- Vokenization adds visual grounding to text-only training.
- Apply to the text component of VLM pretraining.
- The concept extends to grounding any modality with another.
## Implementation notes
- Use CLIP for efficient voken retrieval.
- Cache voken assignments for efficiency.
- Compare to text-only baselines.
## Evidence from the paper
- Vokenization improves language understanding with visual supervision.
- Retrieved visual tokens ground language in visual concepts.
- The approach improves performance on grounding-related NLU tasks.
- Vokenization demonstrates the benefit of cross-modal supervision.
