# CC12M: Conceptual 12M: Pushing Web-Scale Image-Text Pre-Training To Recognize Long-Tail Visual Concepts
## One-line decision
Use this skill when you want to scale up an image-text dataset from 3M to 12M by relaxing filtering criteria to capture long-tail visual concepts. Avoid it when you need very clean data and cannot tolerate increased noise from relaxed filtering.
## Skill metadata
- **Skill type**: relaxed-filtering-for-scale
- **Paper kind**: operational-method
- **Actionability**: high
- **Evidence quality**: full_paper
## Goal
Scale up the Conceptual Captions dataset from 3M to 12M image-text pairs by relaxing filtering criteria, enabling recognition of long-tail visual concepts through broader data coverage.
## Problem signature
- Modality: image-text pairs from web alt-text with relaxed quality filtering.
- Data state: web-crawled alt-text processed with relaxed filters compared to CC3M.
- Scale regime: 12 million image-text pairs (4x CC3M).
- Model requirement: No model required for dataset construction; validated with CLIP and ALIGN-style training.
## Use when
- You need more data coverage than CC3M provides.
- You want to capture long-tail visual concepts underrepresented in smaller datasets.
- You can tolerate slightly noisier data in exchange for better coverage.
## Do not use when
- You need maximally clean, high-precision image-text pairs.
- CC3M's 3M pairs are sufficient for your task.
- You are training on much larger datasets like LAION-5B.
## Required inputs
- **web_crawl**: Web pages with image alt-text.
- **relaxed_filters**: Filtering pipeline with relaxed thresholds compared to CC3M.
- **processing_pipeline**: Image downloading and text cleaning pipeline.
## Optional inputs
- **additional_text_cleaning**: Extra text normalization steps.
- **dedup_filter**: Near-duplicate removal.
## Outputs
- **cc12m_dataset**: 12M image-text pairs with broader concept coverage than CC3M.
- **long_tail_coverage**: Improved representation of rare visual concepts.
## Assumptions and prerequisites
- Relaxing filters increases noise but also captures valuable long-tail examples.
- Scale benefits outweigh noise costs for pretraining.
- Long-tail concepts are important for real-world applications.
## Procedure
1. **Relax CC3M filtering criteria**
Action: Loosen text length, image resolution, and relevance thresholds.
Why: Strict CC3M filters excluded many valid pairs; relaxing captures more.
Note: See paper for details.
2. **Reduce hypernym replacement**
Action: Apply less aggressive entity replacement to preserve specificity.
Why: Over-hypernyming in CC3M removed useful named entities.
Note: See paper for details.
3. **Scale up collection**
Action: Process more Common Crawl dumps to reach 12M pairs.
Why: More data sources increase concept coverage.
Note: See paper for details.
4. **Apply basic quality filters**
Action: Keep essential filters (language detection, minimum length, NSFW removal).
Why: Basic quality is still needed even with relaxed criteria.
Note: See paper for details.
5. **Validate on downstream tasks**
Action: Train vision-language models and evaluate on diverse benchmarks including long-tail tasks.
Why: Demonstrates the value of broader coverage.
Note: See paper for details.
## Parameters to set
- **min_caption_length** — Role: Minimum words for caption inclusion. How to set: Relaxed from CC3M's threshold. Default/range: Relaxed. Effect: Admits shorter but potentially valid captions.
- **hypernym_policy** — Role: Entity replacement aggressiveness. How to set: Less aggressive than CC3M. Default/range: Minimal replacement. Effect: Preserves more named entities and specificity.
- **relevance_threshold** — Role: Image-text relevance filter threshold. How to set: Lower than CC3M. Default/range: Relaxed. Effect: Admits more pairs with some noise increase.
## Validation checks
- CC12M-trained models should outperform CC3M-trained models on long-tail recognition.
- The dataset should cover more visual concepts than CC3M.
- Noise levels should remain manageable despite relaxed filtering.
## Failure modes
- Relaxed filtering admits more noisy and misaligned pairs.
- Some relaxed pairs may be genuinely low quality rather than long-tail.
- The 4x scale increase may not justify the noise increase for all applications.
## Adaptation notes for VLM training
- CC12M is widely used as a pretraining or alignment dataset for VLMs.
- Combine CC12M with LAION data for larger-scale training.
- Use CC12M as a medium-scale validation dataset for filtering experiments.
## Implementation notes
- Use the CC3M pipeline as a starting point and relax specific thresholds.
- Track concept coverage statistics during collection.
- Compare CC3M vs CC12M-trained model performance to validate the tradeoff.
## Evidence from the paper
- CC12M provides 12M image-text pairs by relaxing CC3M's filtering criteria.
- Models trained on CC12M show improved recognition of long-tail visual concepts.
- The 4x scale increase provides meaningful coverage improvements over CC3M.
- CC12M has become a standard medium-scale pretraining dataset for VLM research.
