## Summary

SpeContext addresses long-context inference efficiency by using a distilled language model (DLM) as a retrieval algorithm to identify important KV cache tokens before main LLM inference. This eliminates costly layer-wise retrieval operations. The approach combines lightweight retrieval (head-level attention reuse), asynchronous prefetching with elastic loading, and adaptive memory management.

## Core Technique

**Distilled Model Retrieval:** Train a smaller DLM (e.g., 2B parameters) on the same task as the main LLM. Use its attention patterns to identify which tokens are important in the KV cache. The DLM runs much faster than layer-wise retrieval computations.

**Head-Level Weight Sharing:** Instead of computing separate retrieval heads per layer, share attention weights from the DLM across the main model's layers. This achieves >90% parameter reduction while maintaining retrieval quality.

**Asynchronous Prefetching:** Prefetch important tokens to GPU before they're needed, overlapping memory transfer with computation. Use elastic loading to manage variable context lengths.

**Adaptive CPU Offloading:** As sequence length grows, dynamically offload less-frequently-accessed KV cache layers to CPU, freeing GPU memory while maintaining performance.

## Implementation

**DLM training:** Train a small model with the same architecture but fewer layers/parameters, optimized on your task distribution.

**Retrieval head computation:** For each DLM attention head, extract head-specific attention weights:
```python
dlm_weights = dlm_forward(input, return_attention=True)  # [batch, heads, seq_len, kv_len]
important_indices = topk(dlm_weights, k=sparse_ratio)
```

**KV cache pruning:** Keep only important token representations:
```python
kv_cache = {
    'k': select(cached_k, important_indices),
    'v': select(cached_v, important_indices),
    'indices': important_indices
}
```

**Adaptive management:** Monitor GPU memory; when usage exceeds threshold, offload oldest layers to CPU.

## When to Use

- Long-context inference (10K+ tokens) on memory-constrained hardware
- Applications where retrieval overhead dominates inference time
- Tasks benefiting from sparse attention (high-context dependency variance)
- Scenarios where maintaining full KV cache is prohibitively expensive

## When NOT to Use

- Short-context inference where full attention is fast enough
- Scenarios requiring attention over all context tokens equally
- Tasks where the DLM's retrieval quality degrades significantly
- Applications with strict latency requirements for prefetching overhead

- KV cache optimization and memory-efficient inference
