# X-Token: Projection-Guided Cross-Tokenizer Knowledge Distillation

## Overview
X-Token addresses a fundamental limitation in logit-based knowledge distillation (KD) for LLMs: the teacher and student often use **different tokenizers** (incompatible vocabularies), making direct distribution matching impossible. Existing methods either fall back to black-box KD (ignoring logit-level dark knowledge) or use ad-hoc vocabulary matching that loses information. X-Token introduces two principled, projection-guided KL divergence variants — **P-KL** and **H-KL** — that share a learned sparse projection matrix **W** to align teacher and student logit distributions across incompatible vocabularies. The methods naturally extend to **multiple teachers**.
## The Cross-Tokenizer Problem
Standard logit-based KD minimizes KL divergence between teacher and student output distributions. When vocabularies differ:
- **Different vocabulary sizes** (e.g., Llama 2: 32K tokens vs. GPT-4: 100K tokens)
- **Different tokenization schemes** (BPE vs. SentencePiece vs. tiktoken)
- **Token-level mismatch**: no natural 1-to-1 correspondence between output tokens
- Prior work (e.g., GOLD) uses **vocabulary matching** — partitioning tokens into matched/unmatched subsets, then applying partial KL on the matched subset only
## Failure Modes Identified
X-Token systematically analyzes failure modes of the full-distribution approach (partition-based matching):
### (i) Uncommon-Token Failure
Critical tokens (domain-specific terms, rare words, technical jargon) fall into the **unmatched subset** and are completely **excluded from the KL loss**. The student never learns the teacher's distribution for these tokens. Since uncommon tokens often carry the most domain-specific dark knowledge, this severely limits cross-tokenizer transfer quality.
### (ii) Over-Conservative Matching
Strict **1-to-1 exact string matching** between vocabularies is overly conservative. Tokens that are **near-equivalent** (e.g., "running" vs. "run", "color" vs. "colour", subword splits that span different boundaries) are excluded from alignment. This discards meaningful distributional signal that could guide the student.
**Key insight:** Both failure modes stem from the rigid partition. X-Token eliminates the partition entirely.
## Method: Projection-Guided KL Divergence
X-Token introduces **two KL variants** that share a common sparse projection matrix **W**, enabling flexible, learnable cross-vocabulary alignment.
### The Projection Matrix W
- **Learned sparse matrix** of shape |V_teacher| × |V_student| (or vice versa)
- **Initialization**: from tokenizer-level string rules (BPE merges, SentencePiece unicode IDs, exact/near-exact token matches)
- **Sparsity constraint**: each row has at most k non-zero entries (k ≪ |V|), ensuring computational tractability
- **Learnable**: fine-tuned during distillation to adaptively refine alignments
- **Multi-teacher support**: a separate W_t for each teacher, all projecting into the shared student vocabulary space
### P-KL (Projection KL)
Removes vocabulary partitioning entirely. Instead of splitting tokens into matched/unmatched groups:
1. Teacher logits **l_T** (size |V_T|) are projected through **W** (sparse, |V_T| × |V_S|)
2. Result: **projected teacher distribution** q_T = softmax(l_T · W) in the student's vocabulary space
3. Student distribution p_S (over its own vocabulary |V_S|)
4. **P-KL loss**: KL(p_S || q_T) — standard KL divergence over the *full* student vocabulary
Since W is initialization-aware (captures string-level token relationships), even tokens with no exact match get sensible projections. The projection is **differentiable** — gradients flow back through W.
### H-KL (Hybrid KL)
Retains a hybrid structure that **relaxes strict 1-to-1 matching**. For each student token, instead of requiring an exact match:
1. Find the **top-k teacher token mappings** via W (ranked by projection weight)
2. Align each student token p_S(t) with a **weighted combination** of its top-ranked teacher token probabilities
3. Naturally handles many-to-many token relationships (e.g., one student subword ↔ multiple teacher subwords)
4. Less aggressive than P-KL — retains some structural locality from the original vocabulary
**Trade-off:** P-KL is simpler and more general; H-KL preserves finer-grained alignment structure. Both outperform the partition-based baseline.
### Multi-Teacher Extension
X-Token naturally extends to **N teachers** with incompatible tokenizers:
- Each teacher t has its own projection matrix **W_t**
- For P-KL: compute q_T^{(t)} for each teacher, average projected distributions → ensemble knowledge
- For H-KL: compute per-teacher H-KL losses, sum or average them
- The projection matrices can be **shared or independent** — independent gives more capacity, shared reduces parameters
- **No tokenizer unification** needed — each teacher stays in its native vocabulary

**Ablations:**
- Removing string-rule initialization from W → drops 1.8 points (initialization matters)
- Increasing sparsity k → sweet spot at k=5–10, diminishing returns beyond
- P-KL vs H-KL: P-KL better for large vocabulary disparity; H-KL better when vocabularies partially overlap
