# TACO: Tail-Aware Credit Calibration for LLM Reinforcement Learning
Fixes the "Positive-Credit Contamination" failure mode in critic-free RL methods like GRPO.
## Problem
GRPO-style RL broadcasts the same advantage to all tokens regardless of their probability. Low-probability tail tokens that are contextually erroneous receive identical positive credit to plausible ones within the same trajectory, indiscriminately reinforcing flawed reasoning.
## Solution: TACO (Tail-Aware Credit calibratiOn)
1. **Tail-Risk Scoring**: Compute a tail-risk score incorporating local generation context to assess each token's risk of falling into the unreliable tail
2. **Distinguish unexpected rarity from uncertainty-driven exploration**: Not all low-probability tokens are bad — some are genuinely useful rare patterns
3. **Calibrate positive credit**: Tune positive credit for risky tokens without removing gradients entirely
## Implementation Steps
1. For each token in a rollout, compute local context probability (conditional on preceding tokens)
2. Classify tokens as "tail" vs "normal" using a context-aware threshold
3. For tail tokens, compute tail-risk score based on:
- Token probability under the policy
- Local context coherence signals
4. Apply credit multiplier: `adjusted_advantage = advantage * (1 - tail_risk_score * calibration_factor)`
5. Do NOT zero out gradients for tail tokens — allow accumulation of genuinely useful rare patterns
6. Apply standard GRPO loss with adjusted advantages
## Key Insights
- **Positive-Credit Contamination**: The key failure mode — bad reasoning steps get reinforced alongside good ones
- **Calibration ≠ Elimination**: Tail tokens still get gradient updates, just calibrated ones
- **Training stability**: TACO supports sustained performance gains in long-horizon RL
- **Model-agnostic**: Works across different LLM sizes and architectures
## Pitfalls
- Setting calibration factor too high eliminates all rare-token learning
- Must distinguish contextually erroneous tail tokens from genuinely creative/exploratory ones
- Requires careful threshold tuning per model size
## Verification
- Monitor tail-token gradient norms during training
- Check reasoning quality improves on held-out benchmarks
- Verify training stability over long horizons (no collapse)
