# RL-Triton: High-Performance GPU Kernels for Reinforcement Learning Credit Assignment
This skill implements the RL-Triton framework from arXiv:2608.17641, providing high-performance GPU kernels for reinforcement learning credit assignment algorithms using the Triton programming language.
## Core Methodology
The framework unifies seven different credit assignment algorithms under a single computational primitive based on associative scan operations, enabling efficient GPU implementation with significant speedups over existing approaches.
### Key Contributions
1. **Unified Computational Primitive**: All credit assignment algorithms expressed as variants of associative scan
2. **Triton GPU Implementation**: Custom GPU kernels optimized for credit assignment patterns
3. **Significant Speedups**: 1.6–5.7× faster than state-of-the-art implementations
4. **Memory Efficiency**: Optimized memory access patterns reduce bandwidth requirements
## Supported Credit Assignment Algorithms
- **Discounted Return**: Standard discounted return calculation
- **GAE (Generalized Advantage Estimation)**: Schulman et al.'s advantage estimation
- **TD(λ)**: Temporal difference learning with eligibility traces
- **Impala V-trace**: Importance weighted advantage estimation
- **PPO Clipped Surrogate**: Proximal Policy Optimization objective
- **SAC (Soft Actor-Critic)**: Maximum entropy reinforcement learning
- **CRR (Critic Regularized Regression)**: Offline reinforcement learning algorithm
## Implementation Workflow
### Step 1: Algorithm Selection
- Choose appropriate credit assignment algorithm based on RL setting
- Identify required inputs (rewards, values, policies, etc.)
- Determine sequence length and batch dimensions
### Step 2: Triton Kernel Configuration
- Configure kernel parameters (block size, grid size)
- Set memory layout (contiguous vs strided)
- Optimize for specific hardware (Ampere, Hopper architectures)
### Step 3: Integration with RL Frameworks
- Replace existing credit assignment implementations
- Ensure compatibility with gradient computation
- Handle edge cases (sequence boundaries, padding)
### Step 4: Performance Optimization
- Profile kernel performance using NVIDIA Nsight
- Tune block/grid dimensions for target hardware
- Optimize memory coalescing and shared memory usage
## Parameters and Configuration
- `algorithm`: Credit assignment algorithm to use (default: "gae")
- `gamma`: Discount factor (default: 0.99)
- `lambda`: GAE lambda parameter (default: 0.95)
- `epsilon`: PPO clipping parameter (default: 0.2)
- `alpha`: SAC temperature parameter (default: 0.2)
## Advantages Over Baselines
- **Performance**: 1.6–5.7× speedup across different algorithms
- **Unified Interface**: Single implementation handles multiple algorithms
- **GPU Optimized**: Leverages GPU parallelism effectively
- **Memory Efficient**: Reduced memory bandwidth requirements
## Use Cases
- Large-scale reinforcement learning training
- Real-time RL applications requiring low latency
- Multi-GPU distributed RL training
- Offline reinforcement learning with large datasets
## Pitfalls and Considerations
- **Hardware Dependency**: Optimized for NVIDIA GPUs; may not work on other architectures
- **Framework Integration**: Requires adaptation for different RL frameworks
- **Debugging Complexity**: GPU kernels can be harder to debug than CPU code
- **Memory Constraints**: Large batch sizes may exceed GPU memory limits
