# Multi-Source Multi-View Graph Domain Adaptation with Hyperbolic Residual Encoding
This skill provides the methodology for cross-site Major Depressive Disorder (MDD) identification from resting-state functional magnetic resonance imaging (rs-fMRI) using multi-source multi-view graph domain adaptation with hyperbolic residual encoding, as introduced in the paper "Multi-Source Multi-View Graph Domain Adaptation with Hyperbolic Residual Encoding for Cross-Site MDD Identification from rs-fMRI" (arXiv:2607.29531).
## Core Problem
Cross-site identification of MDD from rs-fMRI is hindered by:
- Inter-site distribution shifts (different scanners, protocols, populations)
- Heterogeneous functional connectivity (FC) views that capture complementary neural relationships
- Distinct site biases and graph topologies across different FC construction methods
- Need to preserve disease-relevant information while achieving cross-view consistency
## Key Innovations
### 1. Multi-View Functional Connectivity Construction
- **Pearson correlation graphs**: Capture linear statistical dependencies between brain regions
- **Sparse representation graphs**: Identify sparse, interpretable connectivity patterns
- **Granger causality graphs**: Model directional causal relationships between time series
### 2. View-Specific Graph Attention Networks
- Each FC view encoded by a dedicated graph attention network (GAT)
- Preserves view-specific topological characteristics and neural relationships
- Enables learning of view-specific node representations
### 3. Dual-Stream Adaptive Fusion
- Explicitly integrates pairwise cross-view interactions
- Maintains cross-view consistency while preserving view-specific information
- Adaptive fusion weights learned based on task relevance
### 4. Hyperbolic Residual Encoding
- Lightweight hyperbolic residual encoding for curvature-aware representation refinement
- Leverages hyperbolic geometry's natural fit for hierarchical brain network structures
- Residual connections preserve original Euclidean features while adding hyperbolic refinement
### 5. Multi-Source Domain Adaptation
- **Class-wise Cauchy-Schwarz alignment**: Reduces inter-source and source-target discrepancies
- **Adversarial learning**: Aligns feature distributions across domains
- **Information maximization**: Encourages discriminative feature learning
- **Confidence-aware pseudo-labeling**: Leverages high-confidence predictions on target domains
## Methodology Steps
### Step 1: Construct Multi-View Functional Connectivity Graphs
- Extract time series from brain parcellation (e.g., AAL, Harvard-Oxford)
- Compute three types of FC matrices:
- Pearson correlation: `corr_matrix = np.corrcoef(time_series)`
- Sparse representation: Use LASSO or graphical lasso for sparse inverse covariance
- Granger causality: Fit VAR models and compute F-statistics for causality
- Convert matrices to graphs with nodes as brain regions and edges as connectivity strengths
### Step 2: Encode Views with Graph Attention Networks
- Apply view-specific GAT layers to each graph
- Learn attention coefficients for neighbor aggregation
- Generate initial node embeddings for each view: `h_v = GAT_v(graph_v)`
### Step 3: Perform Dual-Stream Adaptive Fusion
- Compute cross-view attention between all view pairs
- Calculate fusion weights based on view compatibility and task relevance
- Combine representations: `h_fused = Σ(α_v * h_v)` where α_v are adaptive weights
### Step 4: Apply Hyperbolic Residual Encoding
- Map fused Euclidean representations to hyperbolic space using exponential map
- Apply hyperbolic operations (gyrovector addition, Möbius transformations)
- Use residual connection: `h_final = h_fused + proj(h_hyperbolic)`
- Project back to Euclidean space if needed for downstream tasks
### Step 5: Implement Multi-Source Domain Adaptation
- **Cauchy-Schwarz alignment**: Minimize `||C_s - C_t||_F^2` where C are class-wise covariance matrices
- **Adversarial training**: Train domain discriminator with gradient reversal
- **Information maximization**: Maximize entropy of marginal predictions while minimizing conditional entropy
- **Pseudo-labeling**: Generate labels for target samples with confidence > threshold τ
### Step 6: Train and Evaluate
- Use multiple source domains for supervised training
- Evaluate on multiple unlabeled target domains
- Metrics: Accuracy, AUC, F1-score across all target domains
- Report mean and standard deviation across domains
## Implementation Considerations
### Hyperbolic Geometry Libraries
- Use `geoopt` or `torch-hypertorch` for hyperbolic operations
- Choose appropriate manifold (Poincaré ball, Lorentz model) based on data characteristics
- Tune curvature parameter c based on hierarchical depth of brain networks
### Graph Construction Parameters
- **Pearson correlation**: No additional parameters needed
- **Sparse representation**: Regularization strength λ controls sparsity level
- **Granger causality**: Order p of VAR model affects temporal dependency modeling
### Domain Adaptation Hyperparameters
- Alignment weight λ_align balances domain alignment vs. classification loss
- Confidence threshold τ for pseudo-labeling (typically 0.8-0.95)
- Learning rate for adversarial discriminator (often lower than main network)
### Computational Requirements
- Memory-intensive due to multiple graph views and hyperbolic operations
- Training time scales with number of source domains and graph size
- Consider batch processing for large datasets
## Pitfalls and Limitations
### 1. Hyperbolic Space Selection
- Different hyperbolic models (Poincaré vs. Lorentz) have different properties
- Curvature parameter choice significantly impacts performance
- Automatic curvature learning may be needed for optimal results
### 2. Graph Construction Sensitivity
- FC graph quality depends on preprocessing (motion correction, filtering)
- Different parcellation schemes affect graph topology
- Temporal resolution impacts Granger causality estimation
### 3. Domain Shift Complexity
- Assumes shared label space across domains (same MDD vs. healthy classes)
- May struggle with extreme domain shifts or completely different populations
- Requires sufficient source domain data for effective adaptation
### 4. Computational Complexity
- Hyperbolic operations are more computationally expensive than Euclidean
- Multiple graph views increase memory requirements
- Real-time inference may be challenging for clinical deployment
