# STL Parameter Synthesis for Nonlinear Systems
Methodology for synthesizing parameters of a nonlinear control/plant system so that the resulting trajectories **robustly satisfy a continuous-time Signal Temporal Logic (STL) specification** across a set of uncertain initial conditions — without requiring target time-series data.
## When to Use
- Optimal control / learning where the objective is specified as a **logical/temporal constraint** (e.g., "stay within bounds for t∈[0,5], then reach region R by t=10") rather than a reference trajectory.
- Nonlinear systems with **uncertain initial conditions** (sets, not points).
- You need **provable satisfaction guarantees**, not just empirical rollouts.
- No demonstration data is available — only a formal spec.
## Core Idea
STL gives each trajectory a **robustness value** ρ(τ, φ): positive = satisfies spec φ, magnitude = degree of margin. Parameter synthesis = maximize/minimize robustness over parameters θ while guaranteeing the worst-case initial condition in a set Θ₀ is satisfied.
Two technical components:
1. **Gradient-based optimization over θ** — STL robustness is differentiable w.r.t. states and (via the model) parameters, enabling efficient search in high-dimensional parameter spaces.
2. **Set-based reachability verification** — instead of sampling initial conditions, over-approximate the reachable set from Θ₀ under candidate θ and compute the **worst-case (minimum) robustness** inside that set. This provides a formal guarantee rather than a Monte-Carlo estimate.
## Methodology (Step-by-Step)
1. **Define the STL spec φ** over signals of interest (states/outputs). Decompose into atomic predicates (e.g., `μ(x) = c - x` for "x ≤ c") composed with temporal operators (Globally G, Eventually F, Until U) and time intervals.
2. **Parameterize the controller / system** with vector θ (paper scales to **up to 18 dimensions**).
3. **Compute STL robustness ρ(τ(t), φ)** for a nominal/sampled trajectory as the optimization surrogate.
4. **Over-approximate the reachable set** R(Θ₀, θ, T) using set-propagation (e.g., Taylor-model / zonotope / interval reachability for the nonlinear ODE).
5. **Minimize worst-case robustness** over R: `J(θ) = min_{τ∈R} ρ(τ, φ)`. This is the guarantee objective.
6. **Gradient ascent/descent** on θ to maximize J(θ). Use automatic differentiation through the sim + robustness, or smooth relaxations of min/max in STL.
7. **Verify** the optimized θ: recompute reachable set and confirm `min ρ > 0` (or > margin). If not, tighten the set approximation and re-optimize.
## Implementation Guidance
- **STL robustness recursion** (standard):
- Predicate: ρ(τ, μ) = μ(τ(t)) (signed margin).
- Negation: −ρ.
- Conjunction: min(ρ₁, ρ₂); Disjunction: max(ρ₁, ρ₂).
- Globally G_[a,b] φ: min_{t∈[a,b]} ρ(τ,φ) — smoothness via log-sum-exp or soft-min.
- Eventually F_[a,b] φ: max_{t∈[a,b]} ρ.
- Until: max over start times of (min of prefix robustness and eventual successor).
- **Reachability**: pick a method scaling to your dimension. Low-dim → zonotope/interval; high-dim nonlinear → Taylor-model or scenario-guided sampling with formal bounds.
- **Optimizer**: any gradient method (Adam/L-BFGS) — the paper demonstrates scalability to 18-D.
- **Guarantee vs speed tradeoff**: gradient-only (fast, sampled) for exploration; reachability verification (slow, formal) for the final candidate.
## Pitfalls
- STL min/max are non-smooth — use smooth surrogates (soft-min/soft-max with temperature) for gradients, but verify with the true (hard) robustness.
- Reachability over-approximation must be **sound**; under-approximation gives false guarantees.
- High-dimensional nonlinear reachability is expensive — bound the time horizon T and use decompositions.
- Robustness maximization can exploit "easy" initial conditions if the worst case is not enforced — always drive `min ρ` not `mean ρ`.
## Applications
- Autonomous system safety specs ("always avoid obstacle", "always stay stable").
- Robust controller tuning under parameter/initial-condition uncertainty.
- Formal verification-backed learning for nonlinear plants (robots, power systems, bio systems).
- Interpretable constraint satisfaction when no demonstration data exists.
## Extensions
- Replace STL with scTL / bounded-time LTL for discrete modes.
- Couple with the MPPI / DeePC skills (see `weighted-regularization-deepc-nonlinear`) for data-driven plants.
- Combine with Gaussian-process or Bayesian uncertainty on θ for active specification refinement.
