## Overview
ANN-to-SNN conversion offers a practical, **training-free** route to deploying spiking large language models. However, existing pipelines focus on spike-driven realizations for Transformer linear-algebra operations while providing limited support for key **nonlinear operators** (Softmax, SiLU, normalization), which typically require division, exponentiation, or norm computations not naturally supported by LIF dynamics.
This paper introduces a **plug-and-play framework** that:
1. Decomposes Transformer nonlinearities into three recurring primitives: **division**, **exponentiation**, and **ℓ₂ norms**
2. Realizes these via **population coding using LIF neuron groups** combined with lightweight **bit-shift scaling** (avoiding floating-point arithmetic)
3. Composes these primitives as **modular operator blocks** supporting common Transformer nonlinearities without any fine-tuning
## Key Findings
- Selective replacement of targeted nonlinear operators incurs **< 1% accuracy drop** across all evaluated LLM tasks
- Framework integrates seamlessly into existing ANN-to-SNN pipelines (works with SpikeZIP, SNN-LLM, etc.)
- Bit-shift scaling replaces floating-point division for hardware efficiency
- Population coding uses groups of LIF neurons whose collective firing rates approximate the target nonlinear function
## Technical Details
### Three Primitives
| Primitive | Spike Implementation |
|-----------|---------------------|
| **Division** | Population-coded LIF groups with bit-shift scaling (right-shift approximates division by powers of 2) |
| **Exponentiation** | LIF neuron population with exponential firing rate coding; uses recurrent excitation for approximate e^x |
| **ℓ₂ Norm** | Population-coded Euclidean norm via LIF integrate-and-fire dynamics with feedback normalization |
### Supported Nonlinearities
- **Softmax**: Division + exponentiation
- **SiLU (Swish)**: Multiplication + sigmoid (via exponentiation + division)
- **LayerNorm / RMSNorm**: ℓ₂ norm + division
- **GELU**: Approximated via SiLU-like composition
### Integration
The modular operator blocks are **drop-in replacements** for their floating-point counterparts. No retraining or fine-tuning required — just swap the nonlinearity module in the existing SNN conversion pipeline.
## Methodological Contributions
1. **First training-free solution** for full Transformer nonlinearity support in SNNs
2. **Divorces spike computation from floating-point** — all operations use integer bit-shifts and LIF dynamics
3. **Modular composition** — primitives can be combined to support arbitrary nonlinearities
4. **Preserves sparsity** — population coding maintains event-driven computation advantages
## Applicability
- **Neuromorphic hardware**: Directly deployable on LIF-based neuromorphic chips (Loihi, BrainScaleS, Speck)
- **ANN-to-SNN pipelines**: Can be integrated into SpikeZIP, SNN-LLM, and other conversion frameworks
- **Edge deployment**: Enables transformer-based LLMs on energy-constrained devices
- **Spiking Transformers**: Addresses the core bottleneck in making attention-based models fully spike-compatible
