# Graph-Structured Online Difficulty Estimation for RLVR
This skill implements the graph-based online difficulty estimation framework from arXiv:2608.17941 for efficient Reinforcement Learning with Verifiable Rewards (RLVR) scheduling.
## Core Methodology
The framework addresses inefficient exploration budget allocation in RLVR by providing reliable online difficulty estimates without dedicated probing overhead. It shares rollout feedback across related samples using graph structure.
### Key Components
1. **Difficulty-Aware Sample Graph**: Constructed based on semantic and reasoning similarities between samples
2. **Latent Difficulty States**: Introduced with Potts prior to encourage neighboring samples to share the same state
3. **State-Level Beta-Binomial Model**: Aggregates rollout outcomes associated with each state
4. **Online Mean-Field Variational Algorithm**: Continuously updates latent-state assignments and state-level difficulty as new feedback arrives
## Implementation Workflow
### Step 1: Graph Construction
- Compute semantic similarity between samples using embedding models (e.g., sentence transformers)
- Compute reasoning similarity based on task structure or prompt patterns
- Combine similarities to construct weighted graph adjacency matrix
- Apply thresholding to create sparse graph structure
### Step 2: Latent State Initialization
- Initialize latent difficulty states randomly or based on initial heuristics
- Set Potts prior strength parameter (controls neighborhood influence)
### Step 3: Online Update Loop
For each new rollout feedback:
1. Update Beta-Binomial parameters for affected states
2. Run mean-field variational update for latent state assignments
3. Propagate difficulty estimates to neighboring samples via graph structure
4. Use updated difficulty estimates for sample selection or rollout allocation
### Step 4: Integration with Schedulers
- **Sample Selection**: Prioritize samples with high estimated difficulty but sufficient learnability
- **Rollout Allocation**: Assign more rollouts to difficult samples, fewer to easy ones
- **Cold Start Handling**: Leverage graph structure to provide initial estimates even without direct observations
## Parameters and Configuration
- `similarity_threshold`: Minimum similarity for graph edge creation (default: 0.3)
- `potts_strength`: Strength of neighborhood consistency prior (default: 1.0)
- `beta_prior_alpha`: Prior alpha parameter for Beta-Binomial (default: 1.0)
- `beta_prior_beta`: Prior beta parameter for Beta-Binomial (default: 1.0)
- `update_frequency`: How often to run full variational update (default: every feedback)
## Advantages Over Baselines
- **No Probing Overhead**: Unlike dedicated probing methods, uses existing rollout feedback
- **Cold Start Mitigation**: Graph sharing provides estimates even for unobserved samples
- **Continuous Updates**: Adapts to changing difficulty as learning progresses
- **Staleness Prevention**: Real-time feedback incorporation keeps estimates current
## Use Cases
- Large language model reasoning training with RLVR
- Adaptive curriculum learning for complex reasoning tasks
- Efficient exploration in costly simulation environments
- Multi-task reinforcement learning with varying task difficulties
## Pitfalls and Considerations
- **Graph Quality**: Performance depends on meaningful similarity metrics
- **Computational Overhead**: Graph construction and variational updates add computation
- **Scalability**: For very large datasets, consider approximate graph methods or subgraph sampling
- **Hyperparameter Tuning**: Potts strength and Beta priors may need dataset-specific tuning
