# EEG Foundation Models Blind to Long-Range Temporal Correlations
## Overview
This skill addresses the critical finding that EEG foundation models (FMs) are blind to long-range temporal correlations (LRTC) in neural signals, which are quantified by the detrended fluctuation analysis (DFA) exponent of the alpha-band envelope. This spectral-temporal dissociation underlies their fragility in cross-population transfer scenarios.
## Key Findings
### Experimental Setup
- **Models Tested**: Five EEG FMs spanning raw-waveform (REVE, LaBraM, BENDR) and spectral-input architectures (CBraMod, BIOT)
- **Cohorts**: Two out-of-distribution cohorts plus a Western reference cohort
- **Metrics**: DFA exponent recovery vs. 1/f aperiodic slope recovery
- **Controls**: Order-preserving and residualization controls for pooling effects
### Main Results
1. **LRTC Representation Failure**: None of the five FMs represented long-range temporal correlations in temporal order
2. **Architecture-Specific Dissociation**:
- Raw-waveform models recovered neither DFA exponent nor 1/f slope (R² ≤ 0.12)
- Spectral-input models recovered 1/f strongly (R² = 0.59-0.73) but not DFA across cohorts
3. **Classical Feature Superiority**: A classical DFA feature recovered the exponent (R² = 0.32-0.38 against 0.64 reliability ceiling)
4. **Orthogonality**: LRTC was orthogonal to aperiodic slope (r = -0.06)
5. **Cross-Population Transfer Failure**:
- Frozen REVE embedding did not beat chance (0.45 accuracy)
- DFA exponent transferred directionally but not at family-wise significance
- All five models dominated by recording-site axis (decodable at 0.98-1.00 vs 0.500 chance)
- DFA exponent is site-robust (0.71)
## Methodology
### DFA Exponent Calculation
The DFA exponent quantifies long-range temporal correlations through:
1. Compute alpha-band envelope from EEG signal
2. Apply detrended fluctuation analysis to envelope time series
3. Extract scaling exponent α where α > 0.5 indicates persistent long-range correlations
### Cross-Population Transfer Protocol
1. Train decoder on source population using frozen FM embeddings
2. Test on target population without fine-tuning
3. Compare performance against classical DFA features
4. Control for recording-site effects through montage harmonization
### Spectral-Temporal Analysis
1. Separate spectral (1/f slope) and temporal (DFA exponent) components
2. Probe FM embeddings for both components independently
3. Test orthogonality between components
4. Evaluate site-robustness of each component
## Applications
### When to Use This Skill
- **EEG FM Evaluation**: Assessing whether your EEG foundation model preserves temporal structure
- **Cross-Population Studies**: Understanding limitations in transferring models across demographics
- **Feature Engineering**: Deciding between FM embeddings vs. classical temporal features
- **Model Architecture Selection**: Choosing between raw-waveform vs. spectral-input architectures
- **Robustness Testing**: Evaluating site-robustness of neural representations
### Pitfalls to Avoid
1. **Assuming FM Embeddings Capture Temporal Structure**: FMs may appear to work well on within-population tasks while failing on temporal correlation preservation
2. **Ignoring Spectral-Temporal Dissociation**: Spectral features (1/f) may be preserved while temporal features (DFA) are lost
3. **Overlooking Site Effects**: Recording-site artifacts can dominate FM embeddings, masking true neural signals
4. **Using Only Within-Population Validation**: Cross-population validation is essential for assessing true generalization
## Implementation Guidelines
### Temporal Correlation Assessment
```python
# Example workflow for assessing LRTC preservation
from scipy.signal import welch
import numpy as np
def compute_dfa_exponent(signal, alpha_band=(8, 12)):
# Extract alpha band envelope
# Apply DFA analysis
# Return scaling exponent
pass
def evaluate_fm_temporal_preservation(fm_embeddings, original_signals):
# Compare DFA exponents before/after FM processing
# Calculate correlation coefficients
pass
```
### Cross-Population Transfer Testing
1. **Data Preparation**: Ensure montage harmonization across populations
2. **Baseline Comparison**: Include classical DFA features as baseline
3. **Statistical Testing**: Use family-wise error correction for multiple comparisons
4. **Site Robustness**: Test decoding accuracy for recording site vs. neural content
