# Contrastive On-Policy Thinking (CopT)
Methodology that reverses the standard CoT pipeline: answer first, then think. Uses continuous embeddings as inference-time contrastive verifiers to assess answer reliability and dynamically control reasoning depth.
## Core Problem
Standard CoT treats thinking as a prerequisite for answering, delaying access to plausible answers and incurring unnecessary token costs even when the model can identify an answer before extended thinking (performative reasoning behavior).
## CopT Pipeline
### Phase 1: Draft Answer
- Elicit a draft answer **before** any thinking
- Leverages the model's ability to produce plausible answers directly
### Phase 2: Contrastive Verification
- Recast continuous embeddings as inference-time contrastive verifiers
- Compare model's support for the same generated tokens under:
- **Discrete-token inputs** (standard generation)
- **Continuous-embedding inputs** (embedding-space conditioning)
- Yields a **sequence-level reverse KL estimator** for answer reliability
- Under certain assumptions, expected estimate equals mutual information between unresolved latent state and emitted answer token
- Captures **answer-relevant uncertainty** rather than arbitrary latent uncertainty
### Phase 3: Conditional On-Policy Thinking
- If answer is reliable: return it directly (saves tokens)
- If unreliable: perform further on-policy thinking conditioned on the draft answer
- A second KL estimator **dynamically controls draft-answer visibility**
- Preserves useful partial information
- Reduces risk of being misled by unreliable content
- Reflection and correction based on the draft
## Implementation Pattern
```python
class CopTReasoner:
def __init__(self, model):
self.model = model
def reason(self, question, max_thinking_steps=50):
# Phase 1: Draft answer first
draft_answer = self.model.generate_answer(question)
# Phase 2: Contrastive verification
discrete_logprob = self.model.score_discrete(question, draft_answer)
continuous_logprob = self.model.score_continuous(question, draft_answer)
kl_estimate = discrete_logprob - continuous_logprob # Reverse KL
# Phase 3: Conditional thinking
if kl_estimate < reliability_threshold:
return draft_answer # Trust the draft
# Answer unreliable: think conditioned on draft
thinking_trace = self.model.think_with_draft(
question, draft_answer, max_steps=max_thinking_steps,
draft_visibility=compute_visibility(kl_estimate)
)
return self.model.generate_answer(
question, context=thinking_trace
)
```
## Key Theoretical Insight
The reverse KL estimator measures mutual information between the unresolved latent state and the emitted answer token. This explains why it captures answer-relevant uncertainty specifically, not general model uncertainty.
## Performance
- **+23% peak accuracy** improvement across mathematics, coding, and agentic reasoning
- **Up to 57% token reduction** at comparable or higher accuracy
- No additional training required — purely inference-time method
- Works for general reasoning and agentic tasks
## When to Use
- Any LLM reasoning task where token efficiency matters
- Agentic workflows where fast answers are preferred when available
- When you want to avoid unnecessary long CoT traces
- Tasks where models can often answer directly but need safety verification
- As a drop-in replacement for standard CoT at inference time
## Key Advantages Over Standard CoT
1. **Faster answers**: Get plausible answers immediately when model is confident
2. **Token efficiency**: Skip thinking when draft is verified reliable
3. **Safety**: Only think when verification detects uncertainty
4. **No training**: Purely inference-time method, works with any LLM
5. **Theoretical grounding**: KL estimator has information-theoretic interpretation
