# Active Predictive Filtering for Spiking Transformers
> Novel Spiking Transformer architecture (SAFformer) based on active predictive filtering paradigm, inspired by the brain's predictive coding mechanism. Achieves 80.50% ImageNet-1K accuracy with only 5.88 mJ energy consumption.

## Core Problem
Existing Spiking Transformers follow a **passive reactive paradigm**: they process all visual tokens equally, regardless of task relevance. This leads to:
1. Inability to focus on task-relevant information
2. Substantial computational overhead on redundant visual data
3. Poor accuracy-efficiency tradeoff compared to CNNs/Transformers
## Core Methodology
### Active Predictive Filtering Paradigm
Instead of passively processing all inputs, SAFformer **actively predicts** and **suppresses predictable (redundant) signals**, focusing computational resources on salient, unexpected features. This mirrors the brain's predictive coding mechanism where higher cortical areas generate predictions and only prediction errors propagate.
### Architecture Design
1. **Predictive Filtering Module**: Generates predictions of incoming visual features and computes prediction errors
2. **Error-Driven Attention**: Attention mechanism weighted by prediction error magnitude — high-error (surprising) regions get more attention
3. **Sparse Spike Generation**: Only significant prediction errors trigger spikes, naturally inducing sparsity
4. **Feedback Prediction Pathway**: Higher layers feed predictions back to lower layers for comparison
### Key Innovation
The shift from **passive reactive** → **active predictive**:
- **Passive**: process everything, spike based on input magnitude
- **Active**: predict what's coming, spike only on surprises (prediction errors)
This fundamentally changes the computational paradigm and dramatically improves efficiency.
## Results

## Implementation Guide
### Prerequisites
- PyTorch, SpikingJelly framework
- Understanding of predictive coding and spiking neural networks
### Architecture Skeleton
```python
import torch
import torch.nn as nn
from spikingjelly.clock_driven import neuron, functional
class PredictiveFilteringLayer(nn.Module):
"""Active predictive filtering: predict + compute error."""
def __init__(self, dim):
super().__init__()
self.predictor = nn.Linear(dim, dim)
self.lif = neuron.LIFNode(tau=2.0)
def forward(self, x, prev_prediction):
# Generate prediction from context
prediction = self.predictor(prev_prediction)
# Compute prediction error (what's surprising)
error = x - prediction.detach()
# Spiking on prediction errors only
spike_output = self.lif(error)
return spike_output, prediction
class SAFformerBlock(nn.Module):
"""Spiking Attention with predictive filtering."""
def __init__(self, dim, num_heads):
super().__init__()
self.filter = PredictiveFilteringLayer(dim)
self.attention = nn.MultiheadAttention(dim, num_heads)
self.lif = neuron.LIFNode(tau=2.0)
def forward(self, x, prev_pred):
# Active predictive filtering
spikes, prediction = self.filter(x, prev_pred)
# Attention on prediction errors (sparse)
attn_out, _ = self.attention(spikes, spikes, spikes)
# Integrate and spike
output = self.lif(attn_out)
return output, prediction
```
### Training Strategy
1. Use surrogate gradient learning for spiking neurons
2. Train with standard cross-entropy loss
3. Apply spike regularization to encourage sparsity
4. Use event-based datasets (DVS) for temporal training
## Applications
- Low-power vision Transformers for edge devices
- Event camera processing (DVS data)
- Energy-efficient computer vision
- Neuromorphic hardware deployment
- Real-time visual attention systems
## Key Insights
1. **Predictive coding is a natural fit for SNNs**: The sparse, event-driven nature of spikes aligns perfectly with prediction error coding
2. **Attention on errors, not inputs**: Focusing attention on surprising features is more efficient than attending to everything
3. **Super-additive efficiency**: Combining predictive filtering with spiking attention yields multiplicative efficiency gains
## Pitfalls
- Prediction quality is critical — poor predictions lead to no sparsity
- Needs careful tuning of prediction learning rate vs. main task
- May require more training epochs than standard SNNs
- Prediction pathway adds some overhead; must be lightweight
